The Ultimate Boundaries of Knowledge and Compression Are Revealed by Algorithmic Information Theory

We are constantly changing how we think about data, complexity, and randomness with Algorithmic Information Theory (AIT), a foundational area of theoretical computer science and mathematics. Kolmogorov Complexity (KC), which is the foundation of AIT, is frequently regarded as the most precise indicator of the information contained in a single object, such as a number, a string of text, or a series of bits.

Algorithmic Information Theory (AIT)

In computer science and mathematics, the study of Kolmogorov complexity and other complexity metrics applied to things such as strings or data structures is known as algorithmic information theory. Unlike classical Shannon entropy, which assesses the average information content over a probability distribution, it focuses on the descriptive complexity, or computational complexity, of a single object.

An absolute measure of the information content needed to specify an item is given by AIT. A key theorem pertaining to complexity and probability, initially identified by Ray Solomonoff and subsequently independently published by Andrey Kolmogorov, forms the basis of AIT. Kolmogorov complexity is a term used to describe the larger field that includes probability and descriptive complexity.

What is Kolmogorov complexity?

Kolmogorov complexity is a concept in algorithmic information theory that measures the computational complexity, or descriptive complexity, of an individual object, such as a string of text or a sequence of bits.

K(x) is the formal definition of the Kolmogorov complexity of an object x, which is the length of the shortest computer program (using a fixed, universal Turing machine U) that generates x as its only output before stopping.

where U is a universal Turing machine.

A mathematically sound way to quantify descriptive complexity is provided by KC. It intuitively conveys a situation’s compressibility. A string with a pattern can be produced with a relatively little program, which leads to a low Kolmogorov complexity. A repeating string such as “x = 0101010101010101” is straightforward, for example, since the description may be shortened to “print 01 eight times.”

However, a complicated or algorithmically random thing has a smallest program nearly as long as the item. Since the only short program that can work for a string y that looks random is “print y exactly,” the Kolmogorov complexity is high.

When it comes to lossless data compression, Kolmogorov complexity is the shortest “zip file” that can be created for any type of data. A fixed, additive constant (known as the Invariance Theorem) limits the differences, but this idea is independent of the universal programming language selection.

Example

Let’s take two strings:

  1. x = 0101010101010101
  2. y = 110010000110000111011... (a random-looking string)
  • For x, we can describe it easily: “print 01 eight times.”
    → The program is short → low Kolmogorov complexity.
  • For y, there’s no simple pattern.
    → The shortest program may just be “print y exactly.”
    → The program is long → high Kolmogorov complexity.

Proof and Computational Boundaries

Although Kolmogorov complexity has been defined elegantly, it has significant theoretical constraints.

Uncomputability: One important finding is that the Kolmogorov complexity function K(x) cannot be computed. The exact complexity K(x) of an arbitrary string x cannot be determined by any universal approach. Because certain programs won’t terminate, the Halting Problem’s non-computability prevents any naive attempt to design such a function by iterating over every possible program from succeeding. The Turing-equivalent solution to the halting problem is actually the complexity function K.

Incompleteness Theorem: Adding to the theoretical limits, Chaitin’s incompleteness theorem shows that if a string’s complexity exceeds a threshold L, which varies depending on the formal axiomatic system employed, it cannot be formally proven. Even if the majority of strings are complex and cannot be greatly compressed, the axiomatic approach does not formally prove that a particular string is extremely complicated. Comparable to the Berry paradox and Gödel’s incompleteness theorem is this impossible result.

Kolmogorov complexity and its applications

Three influential individuals, each working independently, share the foundation of Kolmogorov complexity: Gregory Chaitin, who also presented the theorem; Andrey Kolmogorov, whose name is typically associated with the complexity measure; and Ray Solomonoff, who published the influential theorem in 1960 as part of his invention of algorithmic probability.

Unlike traditional Shannon entropy, which calculates the average information content across a probability distribution, AIT gives an absolute measure of the information content for individual items.

Numerous fields are supported by AIT, including:

  • Incompressible or algorithmically random: A string is said to be algorithmically random if all of the computer programs that can generate it are at least as long as the string.
  • Minimum Description Length (MDL): This statistical and inductive inference principle states that the hypothesis that minimizes the total description length—that is, the length of the hypothesis plus the length of the data encoded using that hypothesis—is the most appropriate hypothesis for a dataset.
  • Universal Probability: The probability that does not require a prefix P(x). The equation log 1/P(x)​=K(x)+O(1), which expresses the probability that a universal Turing machine will produce x given a random input stream, is intimately associated with the prefix-free complexity K(x).
  • Biology: It has been suggested that KC favors simpler underlying “programs” (genomes) in evolutionary processes, such as the insect head direction circuit, which arise from minimal Kolmogorov complexity.

Researchers are also still working on complexities like Conditional Kolmogorov Complexity (K(x|y)), which calculates the length of the shortest program to compute x given y as input, and Time-Bounded Complexity, in which the search for the program is time-bounded.
