We discuss the global environmental impact of deep learning. Green AI is at the core of Quantum Machine Learning (QML) discussions. The study, conducted by Sarvapriya Tripathi, Himanshu Upadhyay, and Jayesh Soni, provides an empirical examination of the carbon footprint and energy efficiency of quantum models. The team discovered important trade-offs between the environmental impact and computational performance of particular quantum circuit designs, or ansätze, by evaluating these models against actual cybersecurity threats.

Using the N-BaIoT dataset, the researchers classified network traffic from devices infected with malicious software such as Mirai and Bashlite, concentrating their efforts on IoT botnet identification. The Quantum Neural Network (QNN) and the Quantum Long Short-Term Memory (QLSTM) model are the two main hybrid quantum architectures that they benchmarked to complete this mission. To give a comprehensive picture of the sustainability of quantum AI today, the study was divided into three main stages.

Ten different quantum circuit designs (ansätze A1–A10) with differing depth, rotation gates, and entanglement patterns were assessed by the team in the first phase. During training, they monitored the CPU, GPU, and RAM’s energy use in real time using the CodeCarbon toolbox. The results showed that QNN models continuously performed better than QLSTM models in terms of classification accuracy and energy efficiency. For the same circuit layout, QLSTM models used 25–30% more energy on average than QNNs.

Importantly, the analysis determined that the “Pareto-optimal” arrangement was ans§ A4. This particular architecture, which alternates between global CZ entangling gates and single-qubit rotations, offered the optimum compromise between small carbon footprint and functional efficacy. The researchers discovered that simpler ansá might achieve equivalent accuracy while using much less power, despite the common belief that deeper, more complex circuits perform better. In contrast to more intricate systems like A6, which were noticeably more energy-intensive without offering commensurate improvements, QNN-A4 delivered great accuracy with minimal energy usage.

A thorough energy analysis verified that, in the majority of configurations, GPU utilization accounted for over 70% of overall energy consumption, making it the primary source of power consumption. This demonstrates how computationally expensive it is to simulate quantum circuits on traditional technology since qubit interactions must be replicated.

In the experiment’s second phase, these quantum models were tested against traditional machine learning benchmarks, such as Artificial Neural Networks (ANN), LSTM, and CatBoost. The findings provided a sobering reminder of the state of quantum technology at the moment: classical models were orders of magnitude faster and used less energy. For instance, the QNN took a median of 33 minutes to train, but CatBoost finished in less than ten seconds. This discrepancy highlights the fact that conventional algorithms benefit from decades of advanced development and optimization, whereas quantum AI has theoretical promise.

In the last phase, the energy implications of switching from simulation to real quantum hardware were focused on. The group contrasted execution on the IBM Brisbane quantum computer with training on an emulation environment using NVIDIA A100 GPUs. The outcomes were striking: on actual quantum hardware, the anticipated extrapolated energy consumption for a complete training epoch was over 1,000 kWh, while on the emulated version, it was less than 1 kWh. The non-computational overhead inherent in modern superconducting systems, such as the constant need for error correction subsystems, precision control electronics, and cryogenic cooling, which function regardless of the workload size, is responsible for this enormous disparity.

In conclusion, researchers need to advance towards hardware-aware and efficient optimization if QML is to become a practical and sustainable technology. By considering energy and carbon efficiency as “first-class metrics,” the authors intend to steer the field in the direction of more ecologically conscious development. They contend that strategic circuit design decisions that balance performance with environmental requirements are essential to the development of sustainable artificial intelligence.
